Tigrinya Morphological Segmentation with Bidirectional Long Short-Term Memory 
Neural Networks and its Effect on English-Tigrinya Machine Translation  
(双方向長・短期記憶ニューラルネットワークを用いたティグリーニャ語の形態素分割と
英語ティグリーニャ語機械翻訳への影響) 
 
Natural language has a central role in the communication process of human beings. 
The field of Natural Language Processing (NLP) is the branch of Artificial 
Intelligence that enables machines to understand and process human language. 
NLP products have extensive applications in our day-to-day activities including 
grammar correction, spam filtering, personal digital assistance, language 
translation, recommendation systems, and so on. Significant NLP solutions have 
been reported for resourceful languages such as English. Unfortunately, the same 
is not true for the greater majority of the world languages. For instance, currently, 
Google Translate supports about 100 languages out of over 6000 languages in the 
world. While there are several reasons that contribute to this digital divide, the 
absence or scarcity of resources is a major bottleneck impeding NLP advances in 
low-resource languages.  
Tigrinya is one of the languages with very limited support of language 
resources. It is a morphologically rich Semitic language spoken by over seven 
million people in Eritrea and Ethiopia. We aim to initiate Tigrinya language 
processing from the foundation by constructing essential annotated and 
unannotated text corpora and building fundamental NLP components. In resource 
building, we constructed a news text corpus comprising over 15 million tokens, 
with a lexicon of over 593,000 unique tokens. We processed this corpus to generate 
important word lists including Tigrinya stop words and affix lists. The corpus is 
preprocessed using several tools developed for Ge’ez-to-Latin script transliteration, 
clitics normalization, and text cleaning. In an Earlier research, a part of the corpus 
containing 72,080 tokens was manually annotated for parts-of-speech (POS). In 
this research, we constructed another new resource that consists of over 45,000 
morphologically segmented tokens extracted from the POS tagged corpus. Moreover, 
we compiled and properly aligned an English-to-Tigrinya parallel corpus for 
machine translation research. These resources are employed in the following 
research.  
First, we approached POS tagging as a classification as well as a sequence 
labeling problem employing support vector machines (SVM) and conditional

random fields (CRF) respectively. We utilized the unique morphological patterns of 
Tigrinya to boost performance of particularly unknown words. As a result, our 
method doubled the accuracy of unknown words from around 39% to 80%. Hence, 
the overall accuracy also improved to about 90.89%. Furthermore, we obtained 
91.6% accuracy (state-of-the-art) approaching POS tagging as a 
sequence-to-sequence labeling using bidirectional long short-term memory 
(BiLSTM) networks with word embeddings forgoing feature engineering.  
Second, we presented the first research of morphological segmentation for 
Tigrinya. We explored language-independent character and substring features 
based on CRF. In addition, we obtained state-of-the-art F1 score of 95.07% with 
BiLSTM networks using concatenated character and word embeddings. This 
approach does not require feature engineering to extract linguistic information, 
which is useful for languages lacking sufficient resources. In this research, we 
explored several Begin-Inside-Outside (B-I-O) tagging schemes to discover the 
recommended strategy in Tigrinya morphological segmentation.  
Finally, we explored English-to-Tigrinya statistical machine translation. 
Translation from English to the morphologically rich language Tigrinya has several 
challenges including out-of-vocabulary problem, language model perplexity, and 
poor word alignment. We introduced shallow and fine-grained morphological 
segmentation to mitigate these problems and improve convergence of the two 
languages. Generally, the results showed that translation using the 
morphologically segmented models can improve translation quality.

コロイドゲルは，分散粒子の結合力により，重力下において固体のように巨視的な形状を保
持する程度の弱い構造を持つ．静置状態のゲルにある大きさ以上の力を加えるとその形状が崩
れ粘度が急低下し，流動を開始するという降伏的挙動を示す．このような降伏特性を持つゲル
やソフトマターは化粧品分野などで幅広く用いられている．化粧品として肌に塗布した際は人
間の敏感な感覚が降伏挙動のような複雑な挙動を感じ取るため，降伏挙動は使用感に重要な影
響を与えている．一例として，降伏挙動や変形により粘度が低下するチクソトロピー性を有す
る製品は，伸びがよく良好な使用感を持つことが報告されている．しかし，ゲルにおける降伏
挙動は時間依存性や履歴効果が強い複雑な現象であり，未解明な部分が多い．また，降伏挙動
発生後に流動を停止し静置することで再構造化し，降伏特性が復活するなど特異的な現象もみ
られている．  
本研究では，粘土コロイド分散系ゲルおよびαゲルにおける降伏挙動を含む流動特性の解明
を主な目的とする．また，降伏挙動発生に伴う微視的および巨視的な構造変化を捉え，降伏挙
動の発生を誘起する構造を明らかにすることにより，降伏挙動の発生メカニズムの解明を試み
る．ある組成のゲルはせん断応力を一定割合で増加させることで 2 回の降伏挙動を示す．低応
力における降伏，すなわち第 1 降伏は静置時に形成されるコロイド粒子を結合するゲルネット
ワークの局所的破壊によるせん断層形成に起因し，第 2 降伏はせん断流動において形成される
二次構造の破壊に関係する．第 1 降伏を誘起する構造は降伏後に所定の静置時間を経過するこ
とで再構造化し，元の降伏強度あるいはそれ以上に回復する．コロイドゲルの応力緩和挙動は
3 モードマクスウェルモデルにより近似可能で，各マクスウェル要素はそれぞれ第 1 降伏後の
粘性的特性を表す短時間緩和，再構造化に関係する長時間緩和，さらに第 2 降伏発生に関係し
負の応力を発生させる緩和であることを明らかにした．以下，各章で得られた結果を要約する． 
「第 1 章  序論」では，研究背景と目的について述べた．コロイドゲルの工業的な応用を説明し，ゲル
における降伏挙動および流動特性の複雑さとそれに関係する先行研究を論じた． 
「第 2 章  実験方法」では，本研究において必要な実験装置とその特徴および利点，さらに先述
の課題を克服するためのレオロジー測定手法および観察方法の概略を示した．また，本研究に
おける降伏挙動の定義について実験結果の一例を用いて説明した．また 3 つの観察方法におい
てそれぞれ対象としている現象，およびそれに関係すると思われる構造のサイズを示した．  
「第 3 章  コロイドゲルの降伏挙動および粘弾性特性」では，粘土コロイド分散系ゲルを対象とし，応力
増加試験およびヒステリシスループ試験を実施することで降伏挙動のメカニズムを検討した．粘土と PEO
が同じ重量濃度からなるコロイドゲルでは，応力増加試験において 2 回の降伏挙動を示すことがわかっ
た．1 つは油滴を結合するゲルネットワークからなる初期構造が部分的に破壊され，せん断層が生じるこ
とにより発生する第 1 降伏挙動であり，もうひとつは第 1 降伏後のせん断流動により形成された構造に関

連する第 2 降伏挙動である．巨視的な初期構造は，第 1 降伏応力以下でフック弾性的な弾性特性と非
ニュートン的な粘性特性を併せ持つ粘弾性流体的な特性を示す．また，第 2 降伏応力を超える高いせ
ん断応力が印加されると，弾性エネルギーを保持する構造が破壊されるため，応力を除去してもひずみ
の弾性回復が発生しないことを示した． 
「第 4 章 降伏挙動に伴う光学異方性の発現と巨視的構造変化」では，粘土コロイド分散系ゲル
を対象とし，降伏特性の発生メカニズムを含む流動挙動に関して，流動複屈折測定，外観観察
および顕微鏡観察を実施し，降伏によるマクロ構造の変化を実験的に検討した．第 1 降伏挙動
では流路幅方向においてせん断層が発生し，流動とともにせん断層が厚くなり最終的には油滴間の結
合力が弱まり，クエット流れに近い流動状態に達する．さらにせん断応力・せん断速度が増加すると，第
2 降伏前後の流れにおいてはそれまでとは異なり高分子的な流動複屈折が発生した．このとき，平行円
板間の試料の外周付近では，周方向にわたって均一ではなく，局所的な増粘領域が形成され，輪郭線
に大きなゆがみが発生する．さらにせん断応力を増加させるとやがて輪郭線は円形に戻ることから高応
力域では円板の中心方向へと向かう力（たが力）の発生が確認された．たが力はずり弾性による法線応
力効果に起因するため，この状態においてゲルには絡み合いによる弾性力が作用していることが明らか
となった．この状態の試料に対して動的粘弾性試験を行ったところ損失正接 tan が 1 以下であり，弾性
力が支配的な状態であることが明らかとなった． 
「第 5 章 降伏挙動が応力緩和特性に及ぼす影響」では，αゲルにおける降伏挙動を発生させる構
造について，応力増加試験の繰り返し測定や応力緩和試験をもとに検討を行った．応力増加試験によ
り得られる最初の降伏挙動である第 1 降伏の降伏応力は流動履歴に大きく依存し，直前に与え
られた流動から所定の静置時間を経過することで再構造化が起こり，降伏応力が回復する．α
ゲルの場合は，10 分間の静置により元の降伏強度に回復し，それ以上の静置に対しては時間
とともに少しずつ降伏強度が増加する．また応力増加試験中に急にせん断速度をゼロとして応力
緩和挙動を測定し，応力増加試験により現れる各領域の構造について検討した．緩和挙動は 3 モード・
マクスウェルモデルとよく一致し，3 つのマクスウェル要素はそれぞれ第 1 降伏後の粘性的特性を表す短
時間緩和を有する要素，第 1 降伏を誘起する巨視的構造の再構築に関係する 20〜30 分の長時間緩
和を示す要素，そして第 2 降伏に関係する流動停止後に負の応力を発生させる要素より構成されること
を見いだした． 
「第 6 章 結論」では，本研究において得られた結果を簡潔に述べた． 
以上に示した結論より，コロイドゲルにおける降伏挙動の発生メカニズムを解明し，構造の破壊と再構
築過程を，レオ・オプティック計測を始めとした多面的な観察により明らかにした．

Causality or causal influence governs the relationship between two events. 
Contrary to correlation which does not imply causation; causal influence also requires 
additional counterfactual dependence. In the domain of injury severity, causation is largely 
based on univariate analysis. Individual factor selection by univariate analysis cannot 
optimize the estimation of injury severity and may weaken the accuracy of complex 
decision problems. Therefore, utilizing a multivariate analysis-based approach could lead 
towards more comprehensive and objective results. However, the efficiency of multivariate 
analysis highly depends on the correlation structure of explanatory variables. Even if two or 
more explanatory variables are highly correlated, collinearity or multicollinearity problems 
arise in the analysis. Hence, this study aims to develop a multivariate causal analysis 
approach by reducing the effect of redundancy.  
There are several approaches of causal analysis but there is still lack of causal 
properties. Mougeot has proposed multivariate causal analysis with mutual information that 
identifies the maximum relevance causal factors of injury severity, but it has not been used 
to examine the multicollinearity problem. Based on the logistic regression model, Zhang 
has identified the risk factors of fatigue-related automobile crashes, using principal 
component analysis (PCA) for dimension reduction. However, PCA does not consider the 
response variables in the process of dimension reduction. Peng has proposed minimum 
redundancy maximum relevance (mRMR) method to identify the optimal subset of multiple 
factors. The mutual information-based mRMR is obtained by subtracting the redundancy 
from the relevance. This approach avoids the estimation of multivariate probability and 
does not consider counterfactual dependence in the selection of factor group.  
The proposed multivariate causal analysis based on a modified mRMR approach 
which represents the concept of mRMR in the context of multivariate analysis. Multivariate 
techniques can estimate the relationships among different variables, and can identify the 
counterfactual dependencies exist among them. In the process of modified mRMR, mutual 
information is replaced by multivariate mutual information, and multivariate probability 
distribution function is introduced. Multivariate mutual information can be either positive or 
negative, positive values indicate a redundancy effect between the two variables. In a 
preprocessing step of multivariate causal analysis, input categorical variables are converted 
to the dummy variables which can avoid biased assessments of the impact of explanatory 
variables. This study performs an experimental comparison of modified mRMR and 
maximum relevance (mutual information) method using injury severity database. The data 
were acquired as categorical variables from the National Automotive Sampling 
System/Crashworthiness Data System (NASS-CDs). The result shows that the modified 
mRMR has the highest causality power by using a group of minimal factors; it can explain 
more than 80% of the injury’s severity.  
The main contribution of this study is the development of multivariate modified 
mRMR methodology which can maximise causality power with a group of minimal factors 
and make prediction possible under manipulations and some distribution changes. The 
analysis results indicate that the estimated multivariate mutual information among 
explanatory factors can be utilized to reduce redundancy and improve causality power. The 
multivariate modified mRMR is a powerful method for identifying the strength of the 
relationships between variables of different natures without distribution law constraint.
